Abstract
Pekerjaan optimasi dengan hanya mengandalkan aplikasi CAD ditengah perkembangan teknologi artificial intelligence (AI) saat ini termasuk cara-cara yang konvensional. Cara konvensional masih menimbulkan tantangan signifikan dalam menghasilkan desain yang dibutuhkan untuk teknologi komunikasi modern karena waktu yang dibutuhkan bisa berjam-jam untuk satu iterasi saja. Studi akhir-akhir ini telah banyak memanfaatkan AI untuk membangun framework yang berdasarkan model pengganti (surrogate model) dalam optimasi antena sehingga dapat menghemat waktu, memangkas pekerjaan yang berulang-ulang, dan meningkatkan efisiensi pada proses optimasi desain antena modern khususnya antena jenis planar. Namun, studi sebelumnya masih memerlukan akurasi dalam mensintesis dan meningkatkan ketahanan (robustness) yang menjadi faktor penting dalam optimasi berbasis surrogate untuk antena microstrip persegi panjang. Guna mengatasi masalah pada studi sebelumnya, maka tujuan penelitian ini adalah : (1) membandingkan beberapa pendekatan ML, DL, dan TabNet dalam satu lingkungan evaluasi yang sama; (2) mengembangkan framework optimasi desain antena microstrip persegi panjang berbasis model pengganti yang mendukung optimasi multi-parameter dengan bantuan EA dan analisis sensitivitas; (3) mengembangkan framework terpadu yang menggabungkan ML, PSO, dan DE dengan mekanisme umpan balik berbasis berkas berformat .s1p (Touchstone). Tahapan untuk mencapai tujuan-tujuan tersebut dimulai dari data collection dengan melakukan ekperimen terhadap jenis antena microstrip persegi panjang (RMSA) dengan rentang frekuensi yaitu 1 – 4 GHz. Studi ini membangun generator khusus untuk menghasilkan 1.920 sampel. Setelah data collection dilalui, tahapan selanjutnya adalah melakukan pre-processing yang bertujuan untuk mendapatkan data yang sahih untuk proses training. Pada pre-processing dilakukan pula pembuatan model pengganti untuk menerapkan ML dan EA sebagai salah satu fokus dalam penelitian ini. Model pengganti digunakan mencari metode yang efektif dan menghasilkan efisiensi dalam mengoptimasi desain antena berdasarkan prediksi nilai parameter-parameter geometri antena, input reflection coefficient (S11), VSWR dan bandwidth (BW). Setelah melalui serangkaian tahapan preprocessing, tahap selanjutnya pembuatan surrogate model ML, evaluasi model ML, analisis sensitivitas, dan penerapan EA. Tahapan selanjutnya adalah evaluasi kinerja optimasi sampai kinerja sesuai dengan standar. Setelah itu, tahapn lebih lanjut melakukan validasi dan analisis robustness. Terakhir, realisasi sistem rekomendasi cerdas berbasis web. Jika hasil evaluasi pada percobaan sistem belum maksimal, maka akan dilakukan lagi tahapan desain dan realisasi sistem sampai mencapai kinerja yang sesuai standar. Hasil dari penelitian ini yang pertama (1) menunjukkan bahwa model pengganti ML dengan Random Forest dan XGBoost menghasilkan kinerja prediksi yang kuat. Di samping itu, model DL menunjukkan fleksibilitas arsitektur dan kapasitas representasi yang tinggi, memungkinkan prediksi parameter yang akurat secara konsisten bahkan untuk geometri antena nonlinier. Jaringan Tabular (TabNet), yang mengintegrasikan interpretasi dengan pemrosesan data yang efisien, muncul sebagai alat yang kompetitif, khususnya untuk kasus Multi-Input Multi-Output (MIMO). Dari beberapa metode ML, fokus optimasi tertuju pada Random Forest dan XBoost karena hasil prediksi yang stabil yaitu rata-rata masing-masing MAE = 0,1828, MSE = 0,3246, RMSE = 0,4243 dan R2 = 0,9921 untuk Random Forest. Sedangkan MAE = 0,2443, MSE = 0,4219, RMSE = 0,4417 dan R2 = 0,9916 untuk XBoost. Hasil evaluasi ini menunjukkan bahwa kedua ML tersebut lebih baik dari ML lain yang diamati. Hasil kedua (2) adalah sebuah framework baru yang disebut sebagai Robustness-driven Surrogate Optimization Framework (RDSOF). RDSOF memanfaatkan ML berbasis regresi menggunakan XGBoost yang digunakan untuk memodelkan hubungan antara 11 parameter input geometris dan metrik kinerja antena utama, S11, bandwidth, dan VSWR. Hasilnya menunjukkan bahwa pendekatan DE mencapai kinerja EM yang unggul, khususnya dalam meminimalkan S11. Namun, PSO menunjukkan stabilitas yang lebih besar, seperti yang ditunjukkan oleh perbedaan yang relatif kecil dalam deviasi standar fitness antara konfigurasi default dan yang telah tuning. Secara keseluruhan, RDSOF yang diusulkan menunjukkan kemampuan dalam menyeimbangkan eksplorasi dan eksploitasi sambil menekankan kekokohan dan efisiensi komputasi untuk desain antena jenis RMSA. Hasil akhir (3) menghasilkan framework yang menggabungkan data EM yang dihasilkan dari aplikasi CST Studio Suite, model regresi terawasi, DE, PSO, dan umpan balik pasca-simulasi real-time dari file Touchstone berformat .s1p yang dinamakan Hybrid Learning Optimization Framework (HLOP). Tahap optimasi dirumuskan dalam tiga skenario tujuan: Dominant S11, Baseline, dan Fleksibel BW. Skenario ini memungkinkan proses pencarian untuk memprioritaskan pencocokan impedansi, mempertahankan kinerja antena yang seimbang, atau melonggarkan persyaratan bandwidth ketika tujuan utamanya untuk memposisikan S11 minimum pada frekuensi resonansi target. Hasil menunjukkan bahwa optimasi yang dibantu surrogate model secara substansial meningkatkan pencocokan impedansi dibandingkan dengan desain awal, meminimalkan S11 dari -5,46 dB menjadi di bawah -12 dB pada frekuensi yang diamati sambil mempertahankan VSWR yang layak. Hasil akhir dari framework yang diimplementasi ke dalam aplikasi web mampu mendukung penyetelan parameter secara real-time, visualisasi sensitivitas, perbandingan PSO-DE, dan validasi berbasis CST Studio Suite melalui respon file berformat .s1p yang di-import. Hasil perbandingan memberikan tingkat efisiensi waktu untuk HLOP Framework hampir 5 kali lebih cepat dibanding simulasi CST Studi Suite.

Optimization tasks that rely solely on CAD applications in the current era of artificial intelligence (AI) development are still considered conventional approaches. Conventional methods continue to present significant challenges in producing designs required for modern communication technologies because a single iteration may require several hours to complete. Recent studies have extensively utilized AI to develop surrogate model-based frameworks for antenna optimization, thereby reducing computational time, minimizing repetitive tasks, and improving efficiency in the optimization process of modern antenna designs, particularly planar antennas. However, previous studies still require improvements in synthesis accuracy and robustness, which are important factors in surrogate-based optimization for rectangular microstrip antennas. To address the limitations of previous studies, the objectives of this research are: (1) to compare several Machine Learning (ML), Deep Learning (DL), and TabNet approaches within the same evaluation environment; (2) to develop a surrogate model-based optimization framework for rectangular microstrip antenna design that supports multi-parameter optimization using Evolutionary Algorithms (EA) and sensitivity analysis; and (3) to develop an integrated framework that combines ML, Particle Swarm Optimization (PSO), and Differential Evolution (DE) with a feedback mechanism based on Touchstone files in .s1p format. The stages to achieve these objectives begin with data collection by conducting experiments on rectangular microstrip antennas (RMSA) within a frequency range of 1–4 GHz. This study developed a dedicated generator to produce 1,920 samples. After data collection, the next stage is preprocessing, which aims to obtain valid data for the training process. During preprocessing, a surrogate model is also developed to implement ML and EA as one of the main focuses of this research. The surrogate model is used to identify effective methods and achieve efficiency in antenna design optimization based on the predicted values of antenna geometric parameters, input reflection coefficient (S11), Voltage Standing Wave Ratio (VSWR), and bandwidth (BW). Following the preprocessing stages, the subsequent steps include ML surrogate model development, ML model evaluation, sensitivity analysis, and EA implementation. The next stage is optimization performance evaluation until the performance meets the required standards. This is followed by validation and robustness analysis. Finally, a web-based intelligent recommendation system is developed. If the evaluation results of the system experiments do not achieve satisfactory performance, the system design and implementation stages will be repeated until the required performance standards are achieved. The first result (1) shows that ML surrogate models based on Random Forest and XGBoost provide strong predictive performance. In addition, DL models demonstrate architectural flexibility and high representational capacity, enabling consistently accurate parameter prediction even for non-linear antenna geometries. Tabular Networks (TabNet), which integrate interpretability with efficient data processing, emerge as competitive tools, particularly for Multi-Input Multi-Output (MIMO) cases. Among the evaluated ML methods, optimization efforts focused on Random Forest and XGBoost due to their stable prediction performance, with average values of MAE = 0.1828, MSE = 0.3246, RMSE = 0.4243, and R² = 0.9921 for Random Forest, and MAE = 0.2443, MSE = 0.4219, RMSE = 0.4417, and R² = 0.9916 for XGBoost. These evaluation results indicate that both methods outperform the other ML approaches examined in this study. The second result (2) is a new framework referred to as the Robustness-driven Surrogate Optimization Framework (RDSOF). RDSOF utilizes an XGBoost-based regression model to characterize the relationship between 11 geometric input parameters and the main antenna performance metrics, namely S11, bandwidth, and VSWR. The results indicate that the DE approach achieves superior electromagnetic (EM) performance, particularly in minimizing S11. However, PSO demonstrates greater stability, as indicated by the relatively small differences in fitness standard deviation between the default and tuned configurations. Overall, the proposed RDSOF demonstrates the capability to balance exploration and exploitation while emphasizing robustness and computational efficiency for RMSA design. The final result (3) is a framework that integrates EM data generated from CST Studio Suite, supervised regression models, DE, PSO, and real-time post-simulation feedback from Touchstone files in .s1p format, named the Hybrid Learning Optimization Framework (HLOP). The optimization stage is formulated under three objective scenarios: Dominant S11, Baseline, and Flexible BW. These scenarios allow the search process to prioritize impedance matching, maintain balanced antenna performance, or relax bandwidth requirements when the primary objective is to position the minimum S11 at the target resonant frequency. The results show that surrogate-assisted optimization substantially improves impedance matching compared with the initial design, reducing S11 from -5.46 dB to below -12 dB at the observed frequencies while maintaining acceptable VSWR values. The final implementation of the framework in a web-based application supports real-time parameter tuning, sensitivity visualization, PSO-DE comparison, and CST Studio Suite-based validation through imported .s1p response files. The comparison results indicate that the HLOP Framework achieves nearly five times greater time efficiency than CST Studio Suite simulations.
